IV. The Scientific Research Challenges in the AI Era: When Theories Can Be Mass-Produced on an Assembly Line The case of AI replicating Newton's laws through symbolic regression reveals its immense potential within existing frameworks. It can rapidly search for mathematical formulas that fit experimental data within preset concept libraries and dimensional systems, and even reproduce thousands of years of humanity's accumulated scientific theories in a single day. This ability for theoretical mass production has unprecedentedly enhanced the efficiency of scientific research. However, it also raises two sharp questions: Can AI break free from the constraints of existing frameworks to achieve groundbreaking discoveries? And how can we prevent AI from falling into the trap of pursuing innovation for its own sake? The scientific principles we discussed earlier are precisely the touchstones for solving these two problems. First, existing frameworks define the boundaries of AI's capabilities, not springboards for innovation. The essence of symbolic regression is to play with building blocks within established rules. It can derive F = ma based on the dimensional combination of mass, length, and time, but it can never independently propose a paradigm-shattering concept like spacetime curvature that breaks free from dimensional frameworks. Because the core of AI lies in statistical correlations and rule matching, its training logic inherently rejects unconventional, niche ideas. Ideas that seem counterintuitive are dismissed as overfitting and filtered out. Just as Sun Wukong cannot escape the palm of the Buddha, AI cannot escape the theoretical frameworks set by humans. It can find low-hanging fruit within the framework that has been overlooked, but it cannot actively propose revolutionary concepts that break the framework. The unknown fruits in entirely new domains still require humans to pick. Second, predictability is the primary criterion for filtering AI-generated theories. AI can easily define new physical quantities in parallel universes and construct a completely self-consistent logical system. But this system has no intersection with the real world; it can neither be confirmed nor falsified. If it were incorporated into the mainstream allocation of research resources, it would lead to meaningless resource consumption. A valuable theory must be able to guide practice and predict the future, just as Newtonian mechanics guides engineering and quantum mechanics guides chip development. If we blur this criterion, AI will degenerate into a machine for producing empty theories, steering scientific research toward nothingness. Finally, backward compatibility and Occam's razor are core principles to prevent AI from favoring complexity over simplicity. When faced with multiple theories generated by AI, we should prioritize solutions that introduce the fewest and most necessary new assumptions while maximizing compatibility with existing theories, rejecting redundant and convoluted logic created solely to explain phenomena. This is particularly crucial because AI lacks human pragmatism—it can generate extremely complex formulas to fit data but cannot judge whether those formulas have practical value. Just as new spacetime geometry explains the universe's expansion by introducing the hypothesis of dark matter and dark energy, among the theories AI generates, only patchwork-style optimization solutions are truly worthy of in-depth research. More critically, adherence to these principles directly determines the trajectory of AI-driven research, and its urgency is now more pressing than ever. In the past, even without delving deeply into epistemology and methodology, human scientists could make groundbreaking contributions based on experience and intuition. History records cases of Nobel laureates falling into theological speculation in their later years, but this did not hinder their early scientific achievements. After all, human cognitive biases can be corrected by the hard standard of practical testing, and individual intellectual errors can hardly shake the foundation of the entire scientific system. But AI is different. It is the concrete embodiment of human epistemology, an amplifier of human thought. If, when building an AI research system, we blindly pursue disruptive innovation and lack a human-led screening mechanism, allowing AI to step beyond the boundaries of practical testing, it will mass-produce theories detached from reality. If we ignore the principle of backward compatibility, AI will tend toward extreme models that overturn everything, denying the value of existing theories. This epistemological deviation is no longer an individual intellectual error; it will be infinitely magnified by AI, directly leading the entire research path astray and even triggering the risk of AI losing control. When AI creates a vast number of unverifiable theories, humanity may even exhaust its capacity to test them. V. The Way Forward for AI Research: Multi-Track Development Anchored in Practice Faced with the opportunities and risks of AI-driven research, we are not helpless. The strategy of multi-track development can both preserve the possibility of innovation and avoid meaningless waste of resources. This is entirely consistent with the logic of distinguishing between concept verification, proof of concept (POC), and production environments in software development. 1. **Exploratory Track: Allow Concept Verification for Extreme Models** We can train anti-mainstream AI models specifically for breaking through existing frameworks, much like experimental projects in software development that test new technologies—not seeking practicality, only pursuing conceptual breakthroughs. Such models can be allowed to propose unconventional hypotheses, even introducing entirely new dimensions or geometric frameworks, providing brainstorming material for human researchers. However, it must be clearly stated that the results of the exploratory track serve only as academic references and cannot be directly applied in engineering. They must be strictly separated from the resource allocation of mainstream research. Their value lies in inspiring human thinking, not in directly producing mature theories. 2. **Mainstream Track: Adhere to Scientific Principles with Practical Orientation** AI models oriented toward actual research needs must strictly anchor themselves to the three principles of predictability, backward compatibility, and Occam's razor. The core goal of such models is efficiency improvement—for example, quickly fitting experimental data within existing theoretical frameworks, optimizing formula parameters, and screening for optimal solutions. They act as scientific assistants to researchers. Mainstream-track AI does not pursue disruption but precision. Its value lies in freeing humans from repetitive labor, allowing scientists to devote more energy to the creative work of framework reconstruction. 3. **Bidirectional Verification Mechanism: Human-Led Value Judgment** Regardless of which track's AI results are produced, the ultimate right to judge their value must remain in human hands. AI is the theory producer; humans are the theory filterers. We need to establish a standardized evaluation system that screens AI-generated theories based on three core criteria: falsifiability, compatibility with existing theories, and practical guiding significance. Only theories that pass these three tests deserve resource investment for experimental verification. Those unverifiable speculative theories should be promptly categorized as academic exploration, avoiding occupation of mainstream research resources. VI. Conclusion Science is always a work in progress; AI is a tool, not a replacement. From classical mechanics to relativity, from real numbers to complex numbers, from manual calculation to AI assistance, humanity's exploration of science never stops. The essence of scientific theories is humanity's temporary explanation of the world—always in beta, always awaiting falsification, always expanding boundaries based on backward compatibility. The case of AI replicating Newton's laws through symbolic regression shows us the power of tools. But its inability to break through framework limitations makes us face reality. AI can become an accelerator for scientific research, but it can never replace human metacognitive ability. The core of scientific discovery has never been data fitting or logical deduction, but the courage to break frameworks. This courage stems from human curiosity about the unknown, from questioning existing theories, and from adhering to the principle that practice is the sole criterion for truth. AI can play with building blocks within existing theoretical frameworks, but only humans can create entirely new blocks—the paradigm-shattering concepts and mathematical tools that break through existing frameworks. AI can generate countless beta theories, but only humans, based on the principles of predictability and backward compatibility, can decide which theory is worth promoting to an official version. In the future of AI-human collaborative exploration, only by adhering to the underlying logic of science and balancing innovation and practicality through a multi-track development strategy can innovation always stay on the right path. After all, the ultimate goal of science is not to create perfect theories but to continuously approach the real world—and this process has no end.
